BitDelta: Your Fine-Tune May Only Be Worth One Bit

Large Language Models (LLMs) are typically trained in two phases: pre-training on large internet-scale datasets, and fine-tuning for downstream tasks. Given the higher computational demand of pre-training, it's intuitive to assume that fine-tuning adds less new information to the model, and is thus more compressible. We explore this assumption by decomposing the weights of fine-tuned models into their pre-trained components and an additional delta. We introduce a simple method, BitDelta, which successfully quantizes this delta down to 1 bit without compromising performance. This interesting finding not only highlights the potential redundancy of information added during fine-tuning, but also has significant implications for the multi-tenant serving and multi-tenant storage of fine-tuned models. By enabling the use of a single high-precision base model accompanied by multiple 1-bit deltas, BitDelta dramatically reduces GPU memory requirements by more than 10x, which can also be translated to enhanced generation latency in multi-tenant settings. We validate BitDelta through experiments across Llama-2 and Mistral model families, and on models up to 70B parameters, showcasing minimal performance degradation over all tested settings. 2024: James Liu, Guangxuan Xiao, Kai Li, Jason D. What would you say are the biggest stumbling blocks to a joyful career in veterinary science? The unfortunate reality is that there are many people in the veterinary profession who would not readily use 'joy' and 'work' in the same sentence. But Dr Russel Welsh wants to change that. Dr Russel Welsh is  a veterinarian with over 23 years of experience and a passion for the vet profession and the role it plays in the lives of people and animals. He's worked in multiple sectors of the veterinary industry, including clinically, operationally and in senior executive leadership positions. Some of his previous roles include first an employee and later a co-owner of Village Vet, a 33-site primary and referral care veterinary group in the London and Cambridge area. Russel facilitated the sale of this group first to private equity in 2017 and subsequently to the MARS group, where he stayed on first as Managing Director, then as COO and eventually in the role as Business Development Director at Linnaeus Veterinary Group. This adventure has given him invaluable high-level insights into how our profession works (or sometimes DOESN'T work), so Russel recently resigned his position and took on a new challenge as Chief Operating Officer and Co-founder of Creature Comforts, a new VC funded veterinary start-up that aims to revolutionise the veterinary experience to make it seamless, joyful, fair and transparent by combining bespoke-built tech and world-class designer clinics. This question by johnswentworth nerd sniped me, so I ended up thinking a lot about the relationship between information and control over the world in the simplified scenario of a single tape of bits. The question asked how many bits of optimization one could unlock with a single bit of observation; the answer ended up being "arbitrarily many", as proven by a simple example: suppose you have a rule that says that if the first bits of your action Amatch those of your observation O, then the rest of A gets copied to your target value Y; then there's no limit to how many bits you can copy, and the only information you need to leverage is the knowledge of the secret "key". We know this works because this is exactly how locks work in real life too. If I possess someone's bank account password, or the combination to a safe, or the US nuclear codes, then I'm able to produce disproportionate effects to the tiny size of that knowledge, just because I can also rely on the state of the world and its laws being set up in such a way that I can use that knowledge as a pivot to trigger much bigger effects. The thing I wanted to focus on then was those conditions: even given that I know the "password", what else do I need to know about the world at large, and what limits are there on my power to optimize the final state? I decided to focus on the following model: a world string W of N bits, prepared in some initial state W0, with some regions known and some randomized; a discrete map f that determines the evolution of this world, such that W1=f(W0), W2=f(f(W0)) and so on. The map is reversible, such that there exists an inverse Wi−1=f−1(Wi); The focus on the map being reversible is because in the real world the laws of physics are time symmetric too and microscopically should not destroy information. Irreversible computing allows the deletion of information, which reduces the entropy of the system. In a computer embedded in a larger world this can be compensated by creating entropy somewhere else, but if our string has to represent the entire world, then it should preserve information. The world string has several identifiable regions: an action region A, within which we can set up bits arbitrarily in the initial state; an observation region O, which we can't affect but whose contents we know exactly in the initial state; a target region Y, to which we aim at writing certain bits so as to maximize the mutual information I(Y;G) with some goal string G; two fuel regions F0 and F1, at the ends of the string, filled respectively with all 0s and all 1s. We'll see the use for them in a moment. The map f can be defined as a series of instructions. Since we're doing reversible computing, we can use only one universal logic gate, like the Toffoli gate (CCNOT) or the Fredkin gate (CSWAP). These take three bits as arguments, so once we've decided our gate of choice an entire program can be composed simply of triples of addresses of bits, wherein each address will require L=⌈log2(N)⌉ bits, meaning a program's size is 3L bits/instruction. Consider the simplest possible version of a "lock-like" program, which compares b1 and b2, and if they're identical, it swaps b3 and b4 (note that we can't simply copy b3: that would erase information and not be reversible). We will also need two "fuel" bits f1 and f2 prepared respectively in the 0 and 1 states. The program can be written with just three Fredkin gates: CSWAP b_2 f_1 f_2 CSWAP f_2 b_3 b_4 After this, the two "fuel" bits are used up and can't be relied on any more for future calculations. Conjecture: observing an additional N bits of information can allow a system to perform at most N additional bits of optimization. I want a proof or disproof of this conjecture. I'll operationalize “bits of optimization” in a similar way to channel capacity, so in more precise information-theoretic language, the conjecture can be stated as: if the sender (but NOT the receiver) observes N bits of information about the noise in a noisy channel, they can use that information to increase the bit-rate by at most N bits per usage. For once, I'm pretty confident that the operationalization is correct, so this is a concrete math question. Toy Example We have three variables, each one bit: Action (A), Observable (O), and outcome (Y). Our “environment” takes in the action and observable, and spits out the outcome, in this case via an xor function: Y=A⊕O We'll assume the observable bit has a 50/50 distribution. If the action is independent of the observable, then the distribution of outcome Y is the same no matter what action is taken: it's just 50/50. The actions can perform zero bits of optimization; they can't change the distribution of outcomes at all. On the other hand, if the actions can be a function of O, then we can take either A=O or A=¯O (i.e. not-O), in which case Y will be deterministically 0 (if we take A=O), or deterministically 1 (for A=¯O). So, the actions can apply 1 bit of optimization to Y, steering Y deterministically into one half of its state space or the other half. By making the actions A a function of observable O, i.e. by “observing 1 bit”, 1 additional bit of optimization can be performed via the actions. Operationalization Operationalizing this problem is surprisingly tricky; at first glance the problem pattern-matches to various standard info-theoretic things, and those pattern-matches turn out to be misleading. (In particular, it's not just conditional mutual information, since only the sender - not the receiver - observes the observable.) We have to start from relatively basic principles. The natural starting point is to operationalize “bits of optimization” in a similar way to info-theoretic channel capacity. We have 4 random variables: “Goal” G “Action” A “Observable” O “Outcome” Y Structurally: (This diagram is a Bayes net; it says that G and O are independent, A is calculated from G and O and maybe some additional noise, and Y is calculated from A and O and maybe some additional noise.
