New paper from the Google DeepMind mechanistic interpretability team, led by Sen Rajamanoharan! We introduce JumpReLU SAEs, a new SAE architecture that replaces the standard ReLUs with discontinuous JumpReLU activations, and seems to be (narrowly) state of the art over existing methods like TopK and Gated SAEs for achieving high reconstruction at a given sparsity level, without a hit to interpretability. We train through discontinuity with straight-through estimators, which also let us directly optimise the L0. To accompany this, we will release the weights of hundreds of JumpReLU SAEs on every layer and sublayer of Gemma 2 2B and 9B in a few weeks. Apply now for early access to the 9B ones! We're keen to get feedback from the community, and to get these into the hands of researchers as fast as possible. There's a lot of great projects that we hope will be much easier with open SAEs on capable models! Gated SAEs already reduced to JumpReLU activations after weight tying, so this can be thought of as Gated SAEs++, but less computationally intensive to train, and better performing. They should be runnable in existing Gated implementations. Abstract: Sparse autoencoders (SAEs) are a promising unsupervised approach for identifying causally relevant and interpretable linear features in a language model's (LM) activations. To be useful for downstream tasks, SAEs need to decompose LM activations faithfully; yet to be interpretable the decomposition must be sparse - two objectives that are in tension. In this paper, we introduce JumpReLU SAEs, which achieve state-of the-art reconstruction fidelity at a given sparsity level on Gemma 2 9B activations, compared to other recent advances such as Gated and TopK SAEs. We also show that this improvement does not come at the cost of interpretability through manual and automated interpretability studies. JumpReLU SAEs are a simple modification of vanilla (ReLU) SAEs - where we replace the ReLU with a discontinuous JumpReLU activation function - and are similarly efficient to train and run. By utilising straight-through-estimators (STEs) in a principled manner, we show how it is possible to train JumpReLU SAEs effectively despite the discontinuous JumpReLU function introduced in the SAE's forward pass. Similarly, we use STEs to directly train L0 to be sparse, instead of training on proxies such as L1, avoiding problems like shrinkage. Thanks for listening. They are now our team's preferred way to train sparse autoencoders, and we'd love to see them adopted by the community! This work represents progress on removing attention head superposition. We are excited by this approach but acknowledge there are currently various limitations. In the short term, we will be working on adjacent problems are excited to collaborate with anyone thinking about similar things! Produced as part of the ML Alignment & Theory Scholars Program - Summer 2023 Cohort Summary: In transformer language models, attention head superposition makes it difficult to study the function of individual attention heads in isolation. We study a particular kind of attention head superposition that involves constructive and destructive interference between the outputs of different attention heads. We propose a novel architecture - a 'gated attention block' - which resolves this kind of attention head superposition in toy models. In future, we hope this architecture may be useful for studying more natural forms of attention head superposition in large language models. Our code can be found here. Background Mechanistic interpretability aims to reverse-engineer what neural networks have learned by decomposing a network's functions into human-interpretable algorithms. This involves isolating the individual components within the network that implement particular behaviours. This has proven difficult, however, because networks make use of polysemanticity and superposition to represent information. Polysemanticity in a transformer's multi-layer perceptron (MLPs) layers is when neurons appear to represent many unrelated concepts (Gurnee et al., 2023). We also see this phenomena within the transformer's attention mechanism, when a given attention head performs qualitatively different functions based on its destination token and context (Janiak et al., 2023). Superposition occurs when a layer in a network (an 'activation space') represents more features than it has dimensions. This means that features are assigned to an overcomplete set of directions as opposed to being aligned with e.g. the neuron basis. The presence of polysemanticity means that the function of a single neuron or attention head cannot be defined by the features or behaviours it expresses on a subset of its training distribution because it may serve different purposes on different subsets of the training distribution. Relatedly, superposition makes it misleading to study the function of individual neurons or attention heads in isolation from other neurons or heads. Both of these phenomena promote caution around assigning specific behaviours to individual network components (neurons or attention heads), due to there both being a diversity in behaviours across a training distribution and in their interaction with other components in the network. Although polysemanticity and superposition make the isolated components of a network less immediately interpretable, understanding of the correct functional units of analysis has improved. Progress has been made on both understanding features as directions within an activation space (Elhage et al., 2023) and resolving feature superposition by applying sparse autoencoders to identify highly-interpretable features (Sharkey et al., 2022; Cunningham et al., 2023; Bricken et al., 2023). Attention head superposition for OV-Incoherent Skip Trigrams Superposition in the context of attention heads is less understood. It is however conceivable that an attention block could make use of a similar compression scheme to implement more behaviours than the number of attention heads in the block. One of the oldest gated communities in CT started as the result of Jewish firefighters in Queens, NY wanting to get their children out of the city during a polio outbreak. The firefighters transformed a virgin, 600-acre site by hand into a gorgeous and serene community, featuring what is still one of the most pristine lakes in western CT. Over the years, summer bungalows have been replaced by year-round housing in the Lake Waubeeka community. And, one of the country's most famous musical legends spent her summers growing up there. Pearls and Quotes - Atrial Fibrillation: Situational Assessment of Stroke and Bleeding Risk In patients with persistent atrial fibrillation with tachycardia induced cardiomyopathy, timely restoration of normal rhythm is important. In patients not on established oral anticoagulation one option is to wait 3 weeks on oral anticoagulation prior to considering cardioversion. Another option is to pursue TEE prior to cardioversion as TEE is currently the gold standard imaging modality to exclude a LAA thrombus. Following cardioversion (chemical or electrical), anticoagulation must not be interrupted for 4 weeks due to atrial stunning. This is especially true for patients who have been in atrial fibrillation for an extended period of time. Individualizing assessment of stroke and bleeding risk is imperative when determining perioperative anticoagulation (AC) management. ACC has a helpful app (ManageAnticoag App) to make this easier. When considering AC in triggered atrial fibrillation (e.g., pneumonia, sepsis), it is important to consider the substrate that made the patient susceptible to developing atrial fibrillation. AC is favored in patients with high CHA2DS2-VAsC score and many traditional risk factors for atrial fibrillation as they are at high risk for future development of atrial fibrillation. Atrial fibrillation is a marker of poor outcomes in patients who have undergone coronary artery bypass graft (CABG) surgery. It is unclear if patients should be started on long-term AC for new onset atrial fibrillation after CABG regardless of risk factors. This is currently being investigated in the PACES trial. Notes - Atrial Fibrillation: Situational Assessment of Stroke and Bleeding Risk How do we choose an imaging modality for excluding LAA thrombus exclusion prior to cardioversion? TEE is the gold standard. It also provides other information that is important for management of atrial fibrillation (e.g. LA size/volume, presence/degree of mitral regurgitation/stenosis, ejection fraction). Gated cardiac CTA may have a growing role for evaluation of LAA thrombus. What is the data behind the recommendation for uninterrupted AC following cardioversion and what is atrial stunning? CardioNerds (Amit and Dan) join Dr. Khaled Abdelrahman, Dr. Gurleen Kaur, and Dr. Danny Pipilas from the Brigham and Women's Hospital Residency Program for Italian food and cannolis at the North End in Boston as they discuss the case of an elderly man with primary cardiac lymphoma. They review an approach to intracardiac masses, discuss advantages and disadvantages of various imaging modalities for the evaluation of intracardiac masses, and also delve into anthracycline toxicity. The E-CPR segment is provided by Dr. Ron Blankstein, Associate Director of the Cardiovascular Imaging Program and Director of Cardiac Computed Tomography at Brigham and Women's Hospital. A 76-year-old man with a history of hyperlipidemia presented with one month of progressively worsening fatigue, weight loss, and dyspnea on exertion. Physical exam was notable for a 3/6 systolic murmur at the left upper sternal border, a flopping sound along the sternum heard throughout the cardiac cycle, and JVP elevated to the level of the mandible. TTE revealed a large heterogeneous echodensity in the right ventricular (RV) free wall that extended into the pericardium and into the RV myocardium with mobile components in the RV cavity and obstruction of the RV outflow tract. Nongated CT chest showed a solid nodule in the periphery of the left lower lung lobe. Gated cardiac CTA revealed a large heterogenous mass in the right atrioventricular groove that encased the proximal thoracic aorta and pulmonary artery and invaded the RV myocardium and RV outflow tract along with a large pericardial effusion. On cardiac MRI, the mass was isointense to the myocardium on T1-weighted images, hyperintense on T2-weighted images, and had heterogenous enhancement on late gadolinium enhancement images. Overall, the imaging findings were highly suspicious for cardiac lymphoma which was confirmed with biopsy of the lung nodule; pathology showed a large B cell lymphoma. The patient was treated with R-CHOP therapy (rituximab, cyclophosphamide, doxorubicin, vincristine, and prednisone), and TTE after 6 cycles of chemotherapy demonstrated resolution of the RV mass. There is a large homogeneous mass in the right atrioventricular groove that extends anterior to the right ventricular outflow tract, pulmonary artery, and ascending aorta, measuring up to 9.4 x 7.1 cm (axial) x 13 cm (craniocaudal). The mass encases the proximal thoracic aorta and pulmonary artery. The mass invades the right ventricular myocardium, the right ventricular outflow tract, the pulmonary artery, and proximal main pulmonary artery. There is severe stenosis of the right ventricular outflow tract due to obstruction by the mass. The mass encases the right coronary artery, without compression of the artery. There is enhancement of this mass on delayed contrast imaging. Collectively, these findings suggest cardiac lymphoma. 2. There is a large pericardial effusion, circumferential, measuring up to 2.2 cm adjacent to the right atrium and up to 2.3 cm anterior to the intraventricular septum. There is pericardial enhancement, indicative of pericardial inflammation. 3. This study was not optimized for the assessment of the coronary arteries. However,
