In episode 28 of Recsperts, I sit down with Robin Burke, professor of information science at the University of Colorado Boulder and a leading expert with over 30 years of experience in recommender systems. Together, we explore multistakeholder recommender systems, fairness, transparency, and the role of recommender systems in the age of evolving generative AI.We begin by tracing the origins of recommender systems, traditionally built around user-centric models. However, Robin challenges this perspective, arguing that all recommender systems are inherently multistakeholder—serving not just consumers as the recipients of recommendations, but also content providers, platform operators, and other key players with partially competing interests. He explains why the common “Recommended for You” label is, at best, an oversimplification and how greater transparency is needed to show how stakeholder interests are balanced.Our conversation also delves into practical approaches for handling multiple objectives, including reranking strategies versus integrated optimization. While embedding multistakeholder concerns directly into models may be ideal, reranking offers a more flexible and efficient alternative, reducing the need for frequent retraining.Towards the end of our discussion, we explore post-userism and the impact of generative AI on recommendation systems. With AI-generated content on the rise, Robin raises a critical concern: if recommendation systems remain overly user-centric, generative content could marginalize human creators, diminishing their revenue streams. In dieser Folge steht das Thema »Künstliche Unitelligenz« im Mittelpunkt – ein Begriff, der aus einem Artikel aus dem Spectator stammt: Britain has become a pioneer in Artificial Unintelligence. Was genau verbirgt sich hinter dieser Idee? »Artificial Unintelligence is the means by which people of perfectly adequate natural intelligence are transformed by policies, procedures and protocols into animate but inflexible cogs. They speak and behave, but do not think or decide.« Wie werden aus Menschen mit natürlicher Intelligenz bloß unflexible Rädchen? Wir reflektieren die zunehmende Strukturierung und Standardisierung in Organisationen, um mit wachsender gesellschaftlicher Komplexität umgehen zu können. Ein Ausgangspunkt der Episode ist die Frage, warum wir in immer mehr Organisationen eine strukturelle und individuelle Inkompetenz erleben? Ein Zitat aus dem genannten Artikel fasst es treffend zusammen: »‘I didn't find anything in common in these cases,' I said, ‘except the stupidity of your staff. I expected him to get angry, but he maintained a Buddha-like calm. ‘Oh, I know,' he replied, ‘but that is the standard expected now.'« Wie konnte es so weit kommen? Liegt es an der Industrialisierung, die laut Dan Davies in The Unaccountability Machine besagt: »A very important consequence of industrialisation is that it breaks the connection between the worker and the product.« Oder hat es damit zu tun, wie wir mit Überwältungung durch Information umgehen. »When people are overwhelmed by information, they always react in the same way – by building systems.« Sind Menschen, die individuell denken, in solchen Systemen eher hinderlich als hilfreich? Doch was passiert, wenn komplexe Probleme auftreten, die Flexibilität und Kreativität erfordern? Sind unsere Organisationen überhaupt noch in der Lage, mit unerwarteten Situationen umzugehen, oder arbeiten sie nur noch »maschinenhaft« nach Vorgaben – und das mit einem Maschinenverständnis des 19. Jahrhunderts? Ist die Stagnation, die wir seit Jahrzehnten spüren, ein Symptom dieses Systemversagens? Und wie hängt das mit der sogenannten »Unaccountability Machine« zusammen, die Davies beschreibt und die man im Deutschen vielleicht als »Verantwortungslosigkeits-Maschine« bezeichnen könnte? Kann es sogar sein, dass manche Strukturen bewusst als »self-organising control fraud« gestaltet sind? Ein weiteres damit verbundenes Thema ist: Wie beeinflussen moderne Prognose-Tools wie Recommender Systems unser Verhalten? Dienen sie wirklich dazu, bessere Entscheidungen zu ermöglichen, oder machen sie uns hauptsächlich vorhersagbarer? »Menschen, die dies und jedes gekauft/gesehen haben, haben auch dies gekauft/gesehen« – ist das noch Prognose oder schon Formung des Geschmacks? Und was ist mit wissenschaftlichen Modellen komplexer Systeme, die oft relativ beliebige Ergebnisse liefern? Formen sie nicht auch die Meinung von Wissenschaftlern, Politikern und der Gesellschaft – etwa durch die überall beobachtbare schlichte Medienberichterstattung? Bleibt außerdem der Mensch wirklich »in the loop«, wie oft behauptet wird, oder ist er längst ein »artificial unintelligent man in the loop«, der Empfehlungen des Systems kaum hinterfragen kann? Die Episode wirft auch einen kritischen Blick auf naive Ideologien wie das »Scientific World Management« von Alfred Korzybski, der schrieb: „it will give a scientific foundation to Political Economy and transform so-called ‘scientific shop management' into genuine ‘scientific world management.'“ War dieser Wunsch nach dem Ersten Weltkrieg verständlich, aber letztlich völlig missgeleitet? Und warum erleben wir heute eine Wiederkehr des naiven Szientismus, der glaubt, »die Wissenschaft« liefere objektive Antworten? Wie hängen solche Ideen mit Phänomenen wie »Science Diplomacy« zusammen? Die zentrale Frage der Episode lautet: Wie erreicht man, dass Menschen in Verantwortung korrekt im Sinne des definierten Zwecks der Organisation entscheiden? Doch was ist überhaupt der Zweck eines Systems? Stafford Beer sagt: »The purpose of a system is what it does.« Stimmt der definierte Zweck – etwa Gesundheit im Gesundheitssystem – noch mit der Realität überein? Warum entscheiden Ärzte oft defensiv im eigenen Interesse statt im Interesse der Patienten? Und wie überträgt sich dieses Verhalten auf andere Organisationen – von Ministerien bis hin zur Wissenschaft? Davies beschreibt das ab Beispiel des akademischen Publikationswesens so: „A not-wholly-unfair analysis of academic publishing would be that it is an industry in which academics compete against one another for the privilege of providing free labour for a profitmaking company, which then sells the results back to them at monopoly prices.“ Und weiter: „The truly valuable output of the academic publishing industry is not journals, but citations.“ Was ist aus der Idee geworden, dass die Generierung von neuem und relevantem Wissen die Aufgabe von Wissenschaft, Förderung und Publikationswesen ist? Zum Abschluss stelle ich die Frage: Wie können Systeme so gestaltet werden, dass Verantwortung wieder übernommen wird? Wie balanciert man die Zuordnung von Konsequenzen mit der Möglichkeit, ehrlich zu scheitern – ohne Innovation zu ersticken? Und was sind »Luxury Beliefs« – jene modischen Ideen elitärer Kreise, die sie selbst nicht tragen müssen, während sie für andere zur existenziellen Bedrohung werden? Die Episode endet so mit einem Aufruf zur Diskussion: Wie lösen wir diesen Spagat zwischen Verantwortung und Risiko in einer immer komplexeren Welt? In episode 27 of Recsperts, we meet Alessandro Piscopo, Lead Data Scientist in Personalization and Search, and Duncan Walker, Principal Data Scientist in the iPlayer Recommendations Team, both from the BBC. We discuss how the BBC personalizes recommendations across different offerings like news or video and audio content recommendations. We learn about the core values for the oldest public service media organization and the collaboration with editors in that process.The BBC once started with short video recommendations for BBC+ and nowadays has to consider recommendations across multiple domains: news, the iPlayer, BBC Sounds, BBC Bytesize, and more. With a reach of about 500M+ users who access services every week there is a huge potential. My guests discuss the challenges of aligning recommendations with public service values and the role of editors and constant exchange, alignment, and learning between the algorithmic and editorial lines of recommender systems.We also discuss the potential of cross-domain recommendations to leverage the content across different products as well as the organizational setup of teams working on recommender systems at the BBC. The study aims to investigate how recommender systems shape providers' dynamics and content offerings on platforms, and to provide insights into algorithm designs for achieving better outcomes in platform design. The study reveals that recommender systems have the potential to introduce biases in providers' understanding of user preferences, thereby impacting the variety of offerings on platforms. Moreover, it identifies algorithm design as a critical factor, with item-based collaborative filters showcasing superior performance in contexts where customers exhibit selectivity. In episode 26 of Recsperts, I speak with Sanne Vrijenhoek, a PhD candidate at the University of Amsterdam's Institute for Information Law and the AI, Media & Democracy Lab. Sanne's research explores diversity in recommender systems, particularly in the news domain, and its connection to democratic values and goals.We dive into four of her papers, which focus on how diversity is conceptualized in news recommender systems. Sanne introduces us to five rank-aware divergence metrics for measuring normative diversity and explains why diversity evaluation shouldn't be approached blindly—first, we need to clarify the underlying values. She also presents a normative framework for these metrics, linking them to different democratic theory perspectives. Beyond evaluation, we discuss how to optimize diversity in recommender systems and reflect on missed opportunities—such as the RecSys Challenge 2024, which could have gone beyond accuracy-chasing. Sanne also shares her recommendations for improving the challenge by incorporating objectives such as diversity.During our conversation, Sanne shares insights on effectively communicating recommender systems research to non-technical audiences. In episode 23 of Recsperts, we welcome Yashar Deldjoo, Assistant Professor at the Polytechnic University of Bari, Italy. Yashar's research on recommender systems includes multimodal approaches, multimedia recommender systems as well as trustworthiness and adversarial robustness, where he has published a lot of work. We discuss the evolution of generative models for recommender systems, modeling paradigms, scenarios as well as their evaluation, risks and harms.We begin our interview with a reflection of Yashar's areas of recommender systems research so far. Starting with multimedia recsys, particularly video recommendations, Yashar covers his work around adversarial robustness and trustworthiness leading to the main topic for this episode: generative models for recommender systems. We learn about their aspects for improving beyond the (partially saturated) state of traditional recommender systems: improve effectiveness and efficiency for top-n recommendations, introduce interactivity beyond classical conversational recsys, provide personalized zero- or few-shot recommendations.We learn about the modeling paradigms and as well about the scenarios for generative models which mainly differ by input and modelling approach: ID-based, text-based, and multimodal generative models. This is how we navigate the large field of acronyms leading us from VAEs and GANs to LLMs.Towards the end of the episode, we also touch on the evaluation, opportunities, risks and harms of generative models for recommender systems. Martijn's researches on interactive recommender systems which includes aspects of decision psychology and user-centric evaluation. He was one of the creators of the Practical Bandits tutorial at the World Wide Web conference. Recommender systems (RS) play important roles to match users' information needs for Internet applications. In natural language processing (NLP) domains, large language model (LLM) has shown astonishing emergent abilities (e.g., instruction following, reasoning), thus giving rise to the promising research direction of adapting LLM to RS for performance enhancements and user experience improvements. In this paper, we conduct a comprehensive survey on this research direction from an application-oriented view. We first summarize existing research works from two orthogonal perspectives: where and how to adapt LLM to RS. For the"WHERE"question, we discuss the roles that LLM could play in different stages of the recommendation pipeline, i.e., feature engineering, feature encoder, scoring/ranking function, and pipeline controller. For the"HOW"question, we investigate the training and inference strategies, resulting in two fine-grained taxonomy criteria, i.e., whether to tune LLMs or not, and whether to involve conventional recommendation model (CRM) for inference. Detailed analysis and general development trajectories are provided for both questions, respectively. Then, we highlight key challenges in adapting LLM to RS from three aspects, i.e., efficiency, effectiveness, and ethics. Finally, we summarize the survey and discuss the future prospects. Previously, Saahil was a graduate researcher in the Stanford Machine Learning Group under Professor Andrew Ng, where he researched topics related to deep learning and natural language processing (NLP) in resource-constrained domains like healthcare. His research work has been published in machine learning conferences such as EMNLP, NeurIPS Datasets & Benchmarks, and ACM-CHIL among others. He has publicly released various machine learning models, methods, and datasets, which have been used by researchers in both academic institutions and hospitals across the world, as part of an open-source movement to democratize AI research in medicine. Prior to Stanford, Saahil worked as a product manager at Microsoft on Office 365. We discuss how Froomle provides modularized personalization for customers in the news and e-commerce sectors. In episode number seven, we meet Jacopo Tagliabue and discuss behavioral testing for recommender systems and experiences from ecommerce. Before Jacopo became the director of artificial intelligence at Coveo, he had founded tooso, which was later acquired by Coveo. Jacopo holds a PhD in cognitive intelligence and made many contributions to conferences like SIGIR, WWW, or RecSys. In addition, he serves as adjunct professor at NYU.In this episode we introduce behavioral testing for recommender systems and the corresponding framework RecList that was created by Jacopo and his co-authors. Behavioral testing goes beyond pure retrieval accuracy metrics and tries to uncover unintended behavior of recommender models. RecList is an adaption of CheckList that applies behavioral testing to NLP and which was proposed by Microsoft some time ago. RecList comes with an open-source framework with ready set datasets for different recommender use-cases like similar, sequence-based and complementary item recommendations. Furthermore, it offers some sample tests to make it easier for newcomers to get started with behavioral testing. In episode number six, we welcome Manel Slokom to the show and talk about purpose-aware privacy-preserving data for recommender systems. Manel is a 4th year PhD student at Delft University of Technology. For three years in a row she served as student volunteer at RecSys - before becoming student volunteer co-chair herself in 2021. Besides working on privacy and fairness, she also dedicates herself to simulation and in particular synthetic data for recommender systems - also co-organizing the 1st SimuRec Workshop as part of RecSys 2021.This episode is definitely worth a longer run. Manel and I discussed fairness and privacy in recommender systems and how ratings can leak signals about sensitive personal information. For example, classifiers may exploit ratings in order to effectively determine one's gender. She explains "Personalized Blurring", which is the approach she developed to personalize gender obfuscation in user rating data, as well as how this can contribute to more diverse recommendations.In our discussion, we also touch "data-centric AI", a term recently formulated by Andrew Ng, and how adapting feedback data may yield underestimated effects on recommendations that can lead to "data-centric recommender systems". In episode five my guest is Zeno Gantner, who is a principal applied scientist at Zalando. Zeno obtained his PhD from the University of Hildesheim where he was investigating ML-based recommender systems. As a principal applied scientist he is responsible for strategy, mentoring and setting standards for different initiatives on fashion recommendations impacting over 48 million customers in Europe.We discuss the ramifications and limitations of positive-only implicit feedback, touch on how reinforcement learning and more rating-like feedback can help as well as how to treat multiple feedback levels. In the main part, we turn our focus towards fashion recommendations and the “usual suspects” of typical e-commerce recommender systems. We also discuss the goal of creating more fashion-specific recommendations and making users come back for inspiration. This involves a lot of domain-specific modeling and design of experiences to cater the needs for various user segments: from fashionistas to pragmatic customers. Recommender systems have become omnipresent in our everyday lives exemplified by Netflix telling us what movies to watch, to Amazon suggesting which books we should read, to Instacart promoting specific brands we must buy. We are constantly being influenced and seduced by these algorithms and the humans who designed them. On this month's HDSR podcast we examine the pros and cons of recommender systems as well as the art, passion, and creativity that can be lost when we rely too heavily on them. In episode four my guest is Felice Merra, who is an applied scientist at Amazon. Felice obtained his PhD from Politecnico di Bari where he was a researcher at the Information Systems Lab (SisInf Lab). There, he worked on Security and Adversarial Machine Learning in Recommender Systems.We talk about different ways to perturb interaction or content data, but also model parameters, and elaborated various defense strategies.In addition, we touch on the motivation of individuals or whole platforms to perform attacks and look at some examples that Felice has been working on throughout his research.The overall goals of research in Adversarial Machine Learning for Recommender Systems is to identify vulnerabilities of models and systems in order to derive proper defense strategies that make systems more robust against potential attacks.Finally, we also briefly discuss privacy-preserving learning and the challenges of further robustification of multimedia recommender systems.Felice has published multiple papers at KDD, ECIR, SIGIR, and RecSys. In episode three I am joined by Olivier Jeunen, who is a postdoctoral scientist at Amazon. Olivier obtained his PhD from University of Antwerp with his work "Offline Approaches to Recommendation with Online Success". His work concentrates on Bandits, Reinforcement Learning and Causal Inference for Recommender Systems.We talk about methods for evaluating online performance of recommender systems in an offline fashion and based on rich logging data. These methods stem from fields like bandit theory and reinforcement learning. They heavily rely on simulators whose benefits, requirements and limitations we discuss in greater detail. We further discuss the differences between organic and bandit feedback as well as what sets recommenders apart from advertising. We also talk about the right target for optimization and receive some advice to continue livelong learning as a researcher, be it in academia or industry.Olivier has published multiple papers at RecSys, NeurIPS, WSDM, UMAP, and WWW. Most recent conversations about the future focus on the point where technology surpasses human capability. But they overlook a much earlier point where technology exceeds human vulnerabilities. The Problem, Center for Humane Technology. The short-term, dopamine-driven feedback loops that we have created are destroying how society works. Chamath Palihapitiya, former Vice President of user growth at Facebook. The most popular recommender systems - the Facebook news feed, the YouTube homepage, Netflix, Twitter - are optimized for metrics that are easy to measure and improve, like number of clicks, time spent, number of daily active users, which are only weakly correlated with what users care about. One of the most powerful optimization processes in the world is being applied to increase these metrics, involving thousands of engineers, the most cutting-edge machine learning technology, and a significant fraction of global computing power. The result is software that is extremely addictive, with a host of hard-to-measure side effects on users and society including harm to relationships, reduced cognitive capacity, and political radicalization. Update 2021-10-18: As Rohin points out in a comment below the evidence for concrete harms directly attributing to recommender systems is quite weak and speculative; the main argument of the post does not strongly depend on the last paragraph. In this post we argue that improving the alignment of recommender systems with user values is one of the best cause areas available to effective altruists, particularly those with computer science or product design skills. We'll start by explaining what we mean by recommender systems and their alignment. Then we'll detail the strongest argument in favor of working on this cause, the likelihood that working on aligned recommender system will have positive flow-through effects on the broader problem of AGI alignment. We then conduct a (very speculative) cause prioritization analysis, and conclude with key points of remaining uncertainty as well as some concrete ways to contribute to the cause. Cause Area Definition Recommender Systems By recommender systems we mean software that assists users in choosing between a large number of items, usually by narrowing the options down to a small set. Central examples include the Facebook news feed, the YouTube homepage, Netflix, Twitter, and Instagram. Less central examples are search engines, shopping sites, and personal assistant software which require more explicit user intent in the form of a query or constraints. Aligning Recommender Systems By aligning recommender systems we mean any work that leads widely used recommender systems to align better with user values. Central examples of better alignment would be recommender systems which optimize more for the user's extrapolated volition - not what users want to do in the moment, but what they would want to do if they had more information and more time to deliberate. require less user effort to supervise for a given level of alignment. Recommender systems often have facilities for deep customization (for instance, it's possible to tell the Facebook News Feed to rank specific friends' posts higher than others) but the cognitive overhead of creating and managing those preferences is high enough that almost nobody uses them. reduce the risk of strong undesired effects on the user, such as seeing traumatizing or extremely psychologically manipulative content. Our guest today is Matt Artz. Matt is a business and design anthropologist, consultant, author, speaker, and creator. As a creator he creates podcasts, music, and visual art. Many people will know Matt through his Anthropology in Business and Anthro to UX podcasts. We talk about his interdisciplinary educational background — he has degrees in Computer Information Systems, Biotechnology, Finance and Management Information Systems, and Applied Anthropology — and Matt explains what drew him along this path.He shares his recent realisation that he identifies primarily as a technologist ("I am still at heart a technologist. I love technology. I love playing with technology") and his conflict around the "harm that comes out of some AI, but I'm also really interested in it and to some degree kind of helping to fuel the rise of it."This leads to us discussing — in the context of recommender systems and Google more broadly — how we are forced to identify on the internet as one thing or another, either an anthropologist, a technologist, or a creator but not all three. As Matt explains, "finding an ideal way to brand yourself on the Internet is actually very critical...it's a real challenge".We turn next to recommender systems and his interest in how capital and algorithmic bias contribute to inequality in the creator economy, which is based on his art market research as the Head of Product & Experience for Artmatcher. Artmatcher is a mobile app that aims to address access and inclusion issues in the art market. The work being done on Artmatcher may lead to innovations in the way the approximately 50 million people worldwide in the Creator Economy get noticed in our "technologically-mediated world" as well as in other multi-sided markets (e.g. Uber, Airbnb) where there are multiple players. It's a model he hopes will ensure that people's "hard work really contributes to their own success".Design anthropology is one approach to solving this challenge, Matt suggests, because it is "very interventionist, very much focused on what are we going to do to enact some kind of positive change". As Matt says, "even if this [model] doesn't work, I do feel there's some value in just having the conversation about how can we value human behaviour and reward people for productive effort and how can we factor that back into the broader conversation of responsible tech or responsible AI?".He recommends two books, Design Anthropology: Theory and Practice, edited by Wendy Gunn, Ton Otto, Rachel Charlotte Smith, and Media, Anthropology and Public Engagement, edited by Sarah Pink and Simone Abram.Lastly, Matt leaves us with a hopeful note about what we can do in the face of "really hard challenges" such as climate change.You can find Matt on his website, follow him on Twitter @MattArtzAnthro, and connect with him on LinkedIn.

We introduce into recommenders from a practical perspective discussing the fundamental difference between content-based and collaborative filtering as well as the cold-start problem - no mathematical deep-dive yet, but expect it to follow. In addition, we reason what constitutes good recommendations and briefly touch on a couple of ways of finding that out.Looking a bit into the history of the recommender systems community, we touch on the Netflix Prize that was running from 2006 to 2009 as well as on the RecSys - the leading conference in recommender systems, where we also met for the first time.In the end, we discuss a couple of challenges the field faces, in particular associated with approaches based on deep learning. Besides that, Spiderman will accompany our conversation at certain times. Plus many practical recommendations included on how to get started. One of the consequences of living in a world where we have every kind of data we could possible want at our fingertips, is that we have far more data available to us than we could possibly review. Wondering which university program you should enter? You could visit any one of a hundred thousand websites that each offer helpful insights, or take a look at ten thousand different program options on hundreds of different universities’ websites. The only snag is that, by the time you finish that review, you probably could have graduated. Recommender systems allow us to take controlled sips from the information fire hose that’s pointed our way every day of the week, by highlighting a small number of particularly relevant or valuable items from a vast catalog. And while they’re incredibly valuable pieces of technology, they also have some serious ethical failure modes — many of which arise because companies tend to build recommenders to reflect user feedback, without thinking of the broader implications these systems have for society and human civilization. Those implications are significant, and growing fast. Recommender algorithms deployed by Twitter and Google regularly shape public opinion on the key moral issues of our time — sometimes intentionally, and sometimes even by accident. So rather than allowing society to be reshaped in the image of these powerful algorithms, perhaps it’s time we asked some big questions about the kind of world we want to live in, and worked backward to figure out what our answers would imply for the way we evaluate recommendation engines. That’s exactly why I wanted to speak with Silvia Milano, my guest for this episode of the podcast. Silvia is an expert of the ethics of recommender systems, and a researcher at Oxford’s Future of Humanity Institute and at the Oxford Internet Institute, where she’s been involved in work aimed at better understanding the hidden impact of recommendation algorithms, and what can be done to mitigate their more negative effects. Our conversation took us led us to consider complex questions, including the definition of identity, the human right to self-determination, and the interaction of governments with technology companies.

Igor and Gabriela are fictional characters created by media researcher Dr. Jonathon Hutchinson. In his current project, Jonathon tries to uncover patterns in YouTube’s recommender system. For that purpose he created individual YouTube accounts for five different fictional characters and observed how differently YouTube’s algorithm treats its users. Igor, a 40-something male living in Russia and Gabriela, a grandmother living in Brazil, are exposed to radically different video content when navigating the platform. Prof. Stefano BATTISTON, System Design, ETH Zurich, Switzerland. We propose a novel trust metric for social networks which is suitable for application to recommender systems. It is personalised and dynamic, and allows to compute the indirect trust between two agents which are not neighbours based on the direct trust between agents that are neighbours. In analogy to some personalised versions of PageRank, this metric makes use of the concept of feedback centrality and overcomes some of the limitations of other trust metrics. In particular, it does not neglect cycles and other patterns characterising social networks, as some other algorithms do. In order to apply the metric to recommender systems, we propose a way to make trust dynamic over time. We show by means of analytical approximations and computer simulations that the metric has the desired properties. Finally, we carry out an empirical validation on a dataset crawled from an Internet community and compare the performance of a recommender system using our metric to one using collaborative filtering.

Online retailers may be shooting themselves in the tail -- the long tail that is according to Kartik Hosanagar Wharton professor of operations and information management and Dan Fleder a Wharton doctoral candidate in new research on the ”recommenders” that many of these retailers use on their websites.
